Why traditional CI/CD fails for LLMs (and the release gates we built to fix it)
This article explains why traditional CI/CD gates are not enough for production AI systems. I share a practical release-gating approach for LLM pipelines using baseline evals, drift detection, shadow validation, and cost/latency guardrails. The focus is prevention: catching silent AI regressions before they reach users, based on real platform engineering lessons from production infrastructure.
I deployed an updated RAG pipeline on a Friday afternoon. All evals passed, similarity scores looked great, and by Monday morning, the system was confidently recommending outdated pricing data because the embedding model had drifted just enough to prefer stale chunks over fresh ones. No alert fired, no test failed, the dashboard was green, and the outputs were garbage.
That was the moment I stopped trusting green as a release signal. We did not have a deployment problem. We had a release gate problem. Traditional CI/CD was built for deterministic software. LLMs are probabilistic. Our gates need to be, too.
Why traditional CI/CD fails for LLM pipelines
In normal software delivery, the gate is simple enough: unit tests pass, integration tests pass, security checks pass, deploy. It’s binary. The build is green or red. That model breaks when the thing you’re shipping is behavior.

A production AI system can score 0.82 on relevance today, 0.79 tomorrow, and 0.74 next week. Because no single run ever crosses your failure threshold, nobody gets paged even though your users are already experiencing worse answers.
I spent more than 20 years managing production infrastructure, OpenStack private clouds, database migrations, CI/CD pipelines, and mission-critical systems. In traditional DevOps, we learned that a server reporting 99.9% uptime while dropping 0.1% of financial transactions is not healthy. It’s hiding a bug. LLM evals work the same way. Aggregate scores mask localized failures.
The first failure mode is eval drift: scores degrade gradually, but never enough to fail a hard threshold. The second is distribution shift: real users ask short, messy, weird questions that your clean eval dataset never imagined. The third is context poisoning: your retrieved documents changed, but your tests still ask yesterday’s questions.
A traditional CI/CD gate asks, “Did the test pass?” An LLM release gate asks, “Did behavior stay within an acceptable range?” A normal deployment gate compares expected output to actual output. An AI CI/CD gate compares candidate behavior against historical and production behavior, as well as cost, latency, and risk. Traditional gates fail fast on exceptions. That distinction matters because production AI systems rot rather than explode.
I built llm-eval-drift-release-gates-AGENT because I wanted a gate that treated AI releases like infrastructure releases: measurable, repeatable, and, when possible, boring. Boring is underrated. It lets engineers sleep.
Anatomy of an LLM release gate
The first gate is the baseline eval suite. It runs a fixed dataset against the candidate pipeline and scores relevance, faithfulness, safety, groundedness, and any domain-specific checks you care about. The point isn’t to prove the model is perfect. The point is to catch regressions before they become customer stories.
Here’s a simplified Python structure from the pattern I use:

Using StrEnum keeps the enum string-native without relying on multiple inheritance. That matters in release tooling because status values are often logged, serialized, compared in CI, or passed into dashboards.
This catches obvious failures like relevance collapse, faithfulness drops, unsafe outputs, or malformed evaluator results. If it fails hard, the pipeline blocks immediately; if it triggers a warning, it should require manual approval. I don’t like silent warnings; they are just future incidents dressed in a nice shirt.
The second gate is eval drift detection. A fixed threshold is not enough. If relevance drops from 0.91 to 0.86, your 0.80 threshold says everything is fine. Your users may disagree.
So I compare current scores against a rolling baseline from recent deployments:

The eval suite detected a 6% drop in relevance at 11 p.m. on a Thursday. Without it, that drop would have reached 200 users by Monday. The gate didn’t know the business context. It didn’t need to. It knew the candidate was worse than the last known-good release.
The third gate is shadow traffic validation. Before full rollout, I route a small percentage of real traffic to the candidate pipeline. Users still get the production answer, but the system records candidate output for comparison.
That’s canary deployment, applied to AI. I’ve used the same pattern in infrastructure rollouts, including the ideas behind my eks-canary-deployment-pipeline repo. The difference is that for LLMs, you don’t only compare HTTP 200s. You compare answer quality, retrieved context, latency, and whether the candidate disagrees with production for suspicious reasons.
A judge model can be useful, but I do not let it be the only authority. It produces a signal. The release policy decides.
The fourth gate is cost and latency. A model that scores perfectly but costs 3x more is not a valid release. A RAG pipeline that adds two seconds of latency is not ready either. That thinking also shaped my enterprise-rag-guardrails-costops work.

When this fails, the system blocks the release or routes it to manual approval. I’ve learned not to negotiate with latency during deployment. It always wins later.
These four gates don’t make LLM deployment perfect. They make it harder to ship nonsense with a green badge.
Plugging this into your existing CI/CD
The release gate should not be a separate science project. If your platform team already uses GitHub Actions or GitLab CI, the LLM deployment pipeline should fit into that workflow.
The pattern is boring on purpose:

That is the shape I extended from my devsecops-pipeline-github-actions work. Build the application. Run deterministic tests. Run the baseline eval suite. Compare against rolling baselines. Validate against shadow traffic. Check cost and latency budgets. Deploy only when all gates agree.
This is where MLOps guardrails become useful to platform engineers. You don’t need a separate deployment religion. You need one extra set of checks inside the pipeline your team already trusts.
Here’s a small Python entry point that can be called from CI. The important detail is that it fails gracefully when required reports are missing or malformed, because raw stack traces are not a release strategy.

The best release gate is the one your team actually uses. If it requires a PhD in ML to configure, it’s not a gate. It’s a wall.
I’m pursuing a PhD in Cloud Computing Security, and I don’t even want a deployment process that needs a dissertation every Friday. The gate should be simple enough to run in CI, strict enough to block bad releases, and flexible enough to avoid becoming office decoration.
That last part took me longer to learn than I’d like to admit.
What I got wrong and what I’d do differently
My first version was painfully strict. Every deploy was blocked. The eval suite complained about small wording changes, harmless formatting differences, and borderline score drops. The team started bypassing the gates entirely. That was my fault.

My second mistake was evaluating only on synthetic queries. They were clean, complete, and polite. Real users are not like that. Real users type three words, misspell product names, paste fragments, and expect the system to understand context they never gave.
The evals looked great. Production did not.
My third mistake was not versioning the eval dataset. When I added new edge cases, I lost the ability to compare old releases against new baselines. Now I version eval sets the way I version Terraform state: carefully, with backups, and with mild paranoia.
Building this from Cochabamba, Bolivia, also shaped the design. I didn’t have unlimited cloud credits to burn on huge eval runs. That forced me to optimize sampling, cache judge calls, and separate fast PR checks from heavier nightly checks.
Constraint breeds better engineering. Annoying, but true.
Ship confidence, not just code
In traditional software, we ship code and verify behavior. In AI, we ship behavior and verify alignment. Release gates are how we bridge that gap.
LLM release gates won’t remove uncertainty from production AI systems. Nothing will. But they give platform teams a practical way to catch eval drift, distribution shift, context poisoning, cost spikes, and latency regressions before users do.
That matters for the reliability of agentic workflows. It matters for AI CI/CD. It matters because “all tests passed” is no longer enough.
